## Summary
Instruction tuning works best with high-quality data, but selecting that data usually requires expensive manual curation, as in LIMA. The authors propose InstructMining, an automatic pipeline that scores instruction–response pairs and picks a subset for finetuning LLMs. They use a finetuned model's loss on a curated, unbiased evaluation set as a stand-in for dataset quality. To avoid finetuning a model for every candidate dataset, they fit a least-squares linear model that predicts the log of this loss from cheap indicators. These include reward-model score, perplexity, MTLD lexical diversity, nearest-neighbour distance in SentenceBERT space, and UniEval dialogue scores. While varying subset size, they observe a double descent pattern: quality drives performance for small subsets, and quantity takes over past a threshold. They therefore apply BlendSearch from the FLAML library to find the best number of top-ranked examples. The resulting InstructMining-7B, built on LLaMA-2-7B, uses 2,532 of 100,000 examples and reaches state-of-the-art results on LLM-as-a-judge and the Huggingface Open LLM benchmark. This shows that principled selection can lower training cost while improving model quality.

## Key points
- The final rule combines four indicators: reward score from oasst-rm-pythia-1.4b, plus UniEval understandability, naturalness and coherence. In ablation, the reward score matters most: removing it raises loss by 0.030 on SELF-INSTRUCT and 0.051 on MT-BENCH.
- The optimal subset is about 2.5% of the pool (2,532 / 100,000). It lifts LLaMA-2-7B by 4.93 points on Open LLM and yields answers equal to or better than Vicuna-7B-v1.5 in 64.67% of comparisons.
- Double descent appears on OpenOrca: loss falls, rises after roughly 10,000 examples, then falls again. The quality-selected and random curves eventually cross and converge.
- In robustness tests, selected data beats random data with LLaMA-1-7B, LLaMA-2-13B and LoRA finetuning. The LoRA gain is marginal (SELF-INSTRUCT loss 1.0698 vs 1.0700).
- Open LLM evaluation follows the leaderboard setup: ARC 25-shot, HellaSwag 10-shot, MMLU 5-shot and TruthfulQA zero-shot.
