## Summary
Serving long-context LLMs is constrained by the KV cache. It consumes GPU memory and makes decoding memory-bound. Many speedups keep only the highest-scoring keys (TopK attention). The authors show this is a biased estimator that breaks down when attention is spread out, as in aggregation tasks like common- or frequent-word extraction. They propose MagicPIG, which replaces selection with sampling. SimHash-based locality sensitive hashing approximates sampling in proportion to attention scores, and the sampled terms are reweighted to estimate the attention output. The system splits work across devices: hash codes are computed on the GPU, while hash tables, the KV cache and the reduced attention computation live on the CPU. This frees GPU memory for larger batches and longer contexts. On RULER, MagicPIG stays close to full attention while touching only a few percent of the keys, and it beats Quest. Decoding throughput rises by 1.5–5× across A100, L20 and RTX 4090 setups. The work shows that estimation-based attention can outperform even exact TopK attention.

## Key points
- **Attention is less sparse than assumed.** In some layers, the top 20% of keys capture only about 70% of the attention mass. Sampling keys by their true attention weights ("oracle sampling") cuts estimation error by up to 4× compared with TopK.
- **RULER results with Llama-3.1-8B-Instruct (16K–96K context):**
  - Full attention averages 88.7.
  - MagicPIG scores 86.4–87.6 at a total cost of 0.02–0.05.
  - Quest scores 80.2–82.1 at a cost of about 0.10.
  - The same pattern holds for MegaBeam-Mistral-7B-512K and Llama3-8B-Prolong-512K.
- **Throughput gains:**
  - 1.5× on an A100 serving a 34B model at 16K context.
  - 5.0× on an L20 serving a 13B model at 16K context.
  - Up to 3.3× on a simulated RTX 4090 serving an 8B model at 96K context, with 54 ms single-request latency.
  - Offloading allows batches more than 12× larger than GPU full attention.
- **Implementation:** the GPU side is written in PyTorch and the CPU side in FBGEMM, using bfloat16. LSH is configured by (K, L): K hash bits per table and L tables.
- **Ablations:**
  - Without key centering, fewer than 0.1% of keys are retrieved. NIAH accuracy drops to near zero and FWE falls to 65%.
  - MagicPIG beats exact TopK on CWE by up to 3% and on FWE by up to 8%.

## Interesting ideas
- **Estimate instead of select.** Treat approximate attention as a sampling problem with bias correction rather than a search for the largest scores. Any pipeline that truncates a weighted sum to its top entries could gain from importance sampling with reweighting.
- **Center vectors before hashing.** Shifting keys before hashing fixes a geometric mismatch: queries and keys sit in nearly opposite narrow cones. This check is worth running in any cosine-based retrieval setup where the query and data distributions differ.
- **Handle the attention sink separately.** The sink key is nearly static and points away from the other keys, so it creates the impression of sparsity. Inspecting distributions with the sink excluded gives a more honest picture of how concentrated attention really is.
- **Split hardware by workload type.** Cheap, compute-heavy hashing runs on the GPU, while large tables and memory-bound lookups go to the CPU. This pattern can relieve VRAM limits on modest hardware such as a single RTX 4090.
- **Evaluate on aggregation tasks, not just retrieval.** CWE and FWE exposed failures that NIAH-style needle tests hid. Benchmarks for efficient-inference methods should include tasks that require using the whole context.
