## Summary
Modern language models are usually pre-trained on raw text with next-token prediction, while supervised multitask learning is saved for post-training. This paper asks whether supervised signals can help during pre-training itself. The authors propose Instruction Pre-Training. Each raw document is enriched with synthetic instruction-response pairs grounded in its content, and the model is pre-trained on this augmented text. All other training settings stay unchanged.

The pairs come from an instruction synthesizer. It is a fine-tuned open-source model of about 7B parameters, trained on many reformatted context-based task datasets. Multi-round inference lets it produce few-shot style examples. Using it, the team generated 200M pairs spanning more than 40 task categories.

The method was tested in two settings: pre-training from scratch and domain-adaptive continual pre-training. In both, it beat standard pre-training. Models trained this way also gained more from later instruction tuning. The work matters because it shows a cheap, scalable way to inject supervised multitask data into pre-training without relying on closed-source models.

## Key points
- **Data scale:** the synthesizer produced 200M instruction-response pairs. For the general corpus, they cover 49 task categories grouped into 9 scenarios, with commonsense reasoning the largest share at 23%.
- **Pre-training from scratch:** a 500M model trained on 100B tokens matched a 1B model trained on 300B tokens.
- **Continual pre-training:** Llama3-8B was adapted to finance and biomedicine and became comparable to, or better than, Llama3-70B.
- **Quality of synthetic pairs (GPT-4 evaluation):**

| Corpus | Response accuracy | Context relevance |
|---|---|---|
| General | 77.5% | 92.9% |
| BioMed | 86.2% | 99.4% |
| Finance | 69.8% | 85.8% |

The authors flag possible hallucinations as a limitation, and their experiments stay at the scale of billions of tokens.
- **Resources:** the model, code and data are released via github.com/microsoft/LMOps and huggingface.co/instruction-pretrain.
