## Summary
Parallel reasoning with self-consistency (sampling many chains of thought and taking a majority vote) improves LLM accuracy, but it is costly and its gains flatten as more traces are added. Part of the problem is that every trace gets an equal vote, whatever its quality. The authors propose DeepConf, a test-time technique that uses the model's own token log-probabilities to estimate how reliable each trace is. Instead of averaging confidence over a whole trace, it uses localized signals: sliding-window group confidence, the weakest-scoring segments, and confidence near the end of the trace. In offline mode, DeepConf filters and weights completed traces before voting. In online mode, it halts generation of a trace once its windowed confidence drops below a threshold calibrated on a few warmup traces. The method needs no extra training and was integrated into vLLM with small code changes. On math and science benchmarks it matches or beats plain majority voting while generating far fewer tokens. This makes heavy test-time scaling more affordable.

## Key points
- **Setup:** Benchmarks were AIME 2024/2025, HMMT 2025, BRUMO25 and GPQA-Diamond. Models were DeepSeek-8B, Qwen3-8B/32B and GPT-OSS-20B/120B. Results are averaged over 64 repetitions per setting.
- **Confidence measures:**
  - Token confidence is the negative mean log-probability of the top-k candidate tokens.
  - Traces are scored by group confidence over windows of about 1024–2048 tokens, bottom-10% group confidence, lowest group confidence, or tail confidence over the final ~2048 tokens.
  - Bottom-10% and tail confidence separate correct from incorrect traces better than the plain mean.
- **Offline result:** On AIME 2025 with GPT-OSS-120B (no tools), DeepConf@512 reached 99.9% accuracy, compared with 97.0% for cons@512 and 91.8% for pass@1.
- **Online result:** Early stopping cut generated tokens by up to 84.7% compared with full parallel thinking, with equal or better accuracy. Two variants were tested:
  - DeepConf-low keeps the top 10% of warmup traces.
  - DeepConf-high keeps the top 90%.
  - Both use 16 warmup traces, a 0.95 consensus threshold and budgets of 32–512 traces.
- **Implementation:** Only two vLLM files are modified (`logprobs.py`, `output_processor.py`). The feature is enabled per request through the OpenAI-compatible API by passing `window_size` and `threshold`.
