## Summary
Synthetic data produced by LLMs is now a common way to expand training sets. The methods that create it differ in seed data, generator models, prompts, filters and task-specific tricks, so it is hard to see which design choices actually help. This survey suggests judging generation algorithms by the properties of the data they produce rather than by their recipes. Those properties are quality, diversity and complexity (QDC). The authors first collect the many practical metrics used for each property. They then review evidence on how each property shapes trained models and classify pipeline components by which property they strengthen. Their synthesis is that quality mainly supports in-distribution performance, diversity supports out-of-distribution generalization, and well-calibrated complexity helps both. Quality and diversity often conflict, both within training sets and in model outputs. Most models and benchmarks reward output quality alone, which narrows output diversity. The authors argue this limits RL and recursive self-improvement, and they point to quality-diversity search methods as a promising way to balance the two.

## Key points
- The survey is organized around three research questions: how to define and measure QDC, how QDC in training data affects generalization, and how existing generation algorithms promote each property.
- Typical pipelines secure quality by sampling from a large SOTA teacher model and diversity by starting from a big seed corpus, while complexity is often not addressed. Filter-heavy pipelines discard most of the data they generate (Zhou et al., 2023a).
- The appendix tables catalog the metrics used in the literature:
  - **Diversity:** n-gram statistics, MTLD, average pairwise cosine similarity of embeddings, SemDeDup, NLI diversity and MAP-Elites coverage.
  - **Complexity:** parse tree complexity, instruction length, difficulty level and semantic node count.
  - **Quality:** reward models, perplexity and high-quality-vs-unfiltered classifiers.
- The mechanisms are grouped into generation, filtration and distillation stages:
  - **Complexity:** evolving samples (Xu et al., 2023) and curriculum or weak-to-strong RL.
  - **Diversity:** decoding strategies, diverse seed datasets, deduplication, search and model ensembling.
- The open problems named include benchmarks that measure quality and diversity jointly, algorithms that explicitly manage the output quality-diversity trade-off, and a clearer understanding of how complexity interacts with the other two properties. The authors draw inspiration from classical QD search (Lehman & Stanley, 2011; Mouret & Clune, 2015).
