## Summary
Training neural networks consumes considerable energy, but ML practitioners rarely know how much CO2 their experiments produce. The authors built the Machine Learning Emissions Calculator, a web tool hosted at mlco2.github.io/impact. A user enters three things: the server's region, the GPU model, and how long training ran. The tool returns an approximate figure in CO2-equivalents (CO2eq).

Behind the tool is a public dataset. It brings together hardware power draw, the regions where Amazon Web Services, Microsoft Azure and Google Cloud Platform offer GPUs, the carbon intensity of each local grid, and any offsets a provider purchases. The authors assume each data center draws power from its local grid.

The central finding is that location dominates. Depending on the grid, the same job can emit up to about 40 times more carbon. Hardware choice and wasteful experimental practices also matter.

The paper offers practical advice and acknowledges its limits: aggregate load balancing, opaque provider data, and inference costs are not covered. The tool gives researchers a simple, editable way to estimate their footprint and to treat it as a design decision.

## Key points
- **Tool and data:** The calculator's open data lives in the mlco2/impact GitHub repository. Anyone can correct it through issues and pull requests. The site also includes educational pages on concepts such as RECs and carbon neutrality.
- **Effect of grid location:**
  - Within North America, carbon intensity runs from about 20 g CO2eq/kWh in Quebec to 736.6 g in Iowa.
  - Worldwide, it spans roughly 20 to 820 g, a gap of about 40×.
  - For multi-week runs of models like VGG or BERT, choosing a hydro-powered site can avoid hundreds of kilograms of CO2eq.
- **Hardware efficiency (FLOPS/W, based on TDP):**
  - CPUs can be around 10× less efficient than GPUs.
  - TPUs can be 4–8× more efficient than GPUs.
  - The embedded Jetson AGX Xavier can be 10–20× more efficient than conventional GPUs.
- **Provider factors:**
  - Google Cloud reports an average PUE of 1.1, so about 11% of its energy goes to overhead such as cooling.
  - Google and Azure are certified carbon neutral, the latter with 44% direct renewable supply as of 2016.
  - AWS is not yet fully carbon neutral.
- **Reducing waste:**
  - Prefer fine-tuning pre-trained models over training from scratch.
  - Use random search instead of grid search for hyperparameters.
  - Prevent failed or uninformative runs through testing, early debugging and literature review.
