## Summary
Exam sheets collected by education platforms are usually phone photos. They tend to be skewed and cluttered with handwriting, grading marks or stickers, and the authors call them Real-World Degraded Exam Images (RDEI). Converting such images into clean, question-level structured records is difficult. OCR discards structure such as question boundaries and reading order. MLLMs often invent text the pixels do not support and misplace question and figure regions.

MessToClean is a pipeline that works with any MLLM backbone and runs in three steps:
1. A two-stage fine-tuned RF-DETR detector locates question and figure boxes, which serve as pixel-aligned evidence.
2. The page hierarchy, reading order and question–figure links are rebuilt from these boxes.
3. A Generator-Verifier-Patcher loop compares MLLM output against the cropped regions and applies minimal corrections. It outputs Markdown together with JSONL logs of every edit.

The authors tested the pipeline with 12 backbones on RDEI-Exam, a new benchmark drawn from their own platforms. It improved stem fidelity, figure fidelity and refusal reliability in every case. This makes it practical to build auditable question banks from messy real-world photos.

## Key points
- **RDEI-Exam benchmark:** 12,472 real degraded exam images gathered across multiple regions and schools.
- **Gains across 12 MLLM backbones:**
  - stem consistency improved by 1.01–3.18%;
  - figure consistency improved by 0.50–49.16%;
  - refusal F1 improved by 1.06–10.88%.
- **Pipeline matters more than scale:** with MessToClean, the 8B Qwen3-VL outperformed its 30B sibling and roughly matched the 106B GLM-4.6v.
- **Detector training:** stage 1 uses synthetic occlusions with a "partial" class; stage 2 calibrates on real data.
  - Compared with single-stage training, the full recipe raised mAP_base@50:95 by 8.2 points and AP_Partial by 6.8 points, reaching 79.3 and 67.8.
  - Stage 2 alone added 29.7 points of AP_Partial.
- **Rotation sensitivity:** backbones averaged a StemSim of 65.7% at right-angle rotations but only 26.6% at oblique ones. The worst case was 11.3% at 135°.
