## Summary
Reinforcement learning with verifiable rewards (RLVR) trains long chain-of-thought models using only a final correct/incorrect signal. That signal says nothing about which reasoning steps actually helped. Models therefore keep verifying after they have already solved a problem ("Over-Checking"), and they sometimes revise a correct answer into a wrong one, which the authors call Right-to-Wrong (R2W) failure.

To make step-level progress visible, the authors split each trajectory into steps and add a probe after each one. The probe forces the model to state a provisional boxed answer. From several short probe samples they measure confidence and correctness, then merge the two into a "Step Potential" score.

SPAE builds on a DAPO plus Reinforce++-Baseline backbone. It rewards steps that raise potential, punishes steps that lower it, and penalizes tokens generated once potential has saturated.

On math benchmarks and GPQA, using Qwen and Llama models, SPAE improves accuracy while cutting response length by about a quarter. It beats RL, efficient-reasoning, and token-level advantage baselines, showing that dense step-level credit can come without any learned reward model.

## Key points
- **Probe design:** the trigger "**Final Answer** \n\\boxed{" is inserted at each ".\n\n" step boundary, and every probe is allowed to generate no more than 10 tokens. The probe adds no learnable parameters, and its extra cost is largely offset by shorter policy outputs.
- **Main result on DeepSeek-R1-Distill-Qwen-7B:**

  | Benchmark | Length reduction | Accuracy gain |
  |---|---|---|
  | AIME2024 | 25.1% | +6.7 |
  | AIME2025 | 25.3% | +3.3 |
  | GPQA | 24.4% | +1.1 |

- **Reasoning behavior on AIME 2024/2025:**
  - Post-solution checking drops from 1,511 tokens (Base) to 614.
  - The R2W rate falls from 8.10% to 2.65%.
  - Accuracy reaches 51.05%, the best among compared methods, including DAPO, RF-B, DAST and LC-R1.
- **Ablations:**
  - Full SPAE reaches 63.86% average accuracy.
  - Dropping confidence from the potential gives 62.43%.
  - Removing difference shaping (ξ=0) gives 62.47%.
  - Removing the saturation penalty (α=0) leaves accuracy about the same but lengthens responses from 6,825 to 7,517 tokens.
  - The best setting is ξ=α=0.5.
- **Limitations:** the method relies on structured long-CoT output and a delimiter heuristic, and it has only been tested on mathematical reasoning. Code is available at github.com/cii030/SPAE-RL.
