## Summary
Continual pre-training of an LLM on a narrow target field, such as math, often causes catastrophic forgetting of general skills. Mixing source and target data by domain helps, but existing reweighting schemes depend on hand-crafted heuristics. The authors propose Data Mixing Agent, a small learned policy that sets domain proportions step by step during training. Domain reweighting is framed as a Markov Decision Process. Domains come from the Nvidia domain classifier, which assigns each field's data to 26 categories. The training data for the agent is built as follows:

- Hundreds of random mixing trajectories over DCLM (general data) and the Dolmino-mix-1124 math split are sampled.
- Small proxy models are trained on each trajectory.
- Each checkpoint is scored in a cheap evaluation environment using per-token log probability.

The agent is then trained on these trajectories and scores with Conservative Q-Learning (CQL). Compared with static and dynamic reweighting baselines, it gives better balance between general and math benchmarks. It also transfers to new source data, models, domain spaces, and code generation without retraining. This suggests data-mixing heuristics can be learned once and reused.

## Key points
- **Agent training data:** 384 sampled trajectories, generated by an inductive scoring procedure that favours smooth, diverse, target-leaning distributions.
- **Main result:** an average gain of 3.02% across 8 general and 4 math benchmarks over RegMix and a dynamic baseline (Xia et al., 2023).
- **Generalization without retraining:** the agent transfers to 3 unseen source fields, 4 target models, 2 domain spaces, and the code generation field.
- **Data efficiency:** with a 21B-token budget, DataAgent RL stopped early at 19.92B tokens and DataAgent SFT at 18.86B, saving up to 2.14B tokens while still beating RegMix.
- **Start-state estimation:** when pre-training data is unavailable, the start state can be estimated from a model's own generated text. This was validated on five Pythia models via KL divergence.
- **Stated limitation:** the agent may perform poorly when the target field differs strongly from the source field (e.g., medical).
