## Summary
This survey targets a practical gap in research on efficient LLM inference. Many acceleration techniques exist, but there has been no unified way to reason about why they help on real hardware. The authors build their review around the Roofline model. It relates a workload's demands to a device's compute capacity and memory bandwidth, which shows whether a step is limited by computation or by data movement.

They implement this analysis in an open-source tool, LLM-Viewer. It takes a model's layer configuration, inference settings and hardware specs, then reports the bottleneck, the memory footprint and the attainable performance. Using this lens, they classify the literature into four groups:

- parameter-level compression
- fast decoding algorithms
- compiler/system optimizations
- hardware-level designs

For each group they explain the effect on memory traffic versus arithmetic. The work also explains why LLM decoding tends to be memory-bound and how to pick suitable hardware. This matters for teams with limited compute, who need to know which optimizations will actually pay off before investing in them.

## Key points
- **LLM-Viewer inputs and outputs.** The tool takes an LLM (e.g., LLaMA, Vicuna) and a hardware target (e.g., Nvidia A100, Intel 13900K). It also takes these settings:
  - batch size
  - sequence length
  - quantization bitwidth
  - FlashAttention on/off
  - inference stage
  - decoding method

It outputs peak performance, the bottleneck, the memory footprint and batch-size/performance curves.
- **Two inference stages.** The prefill stage processes the whole prompt and builds a per-layer KV cache. The decode stage generates one token at a time, reusing and extending that cache.
- **Taxonomy of techniques.** The survey groups methods into four areas:
  - Model compression: quantization (QAT, PTQ, Q-PEFT), pruning, knowledge distillation, factorization.
  - Fast decoding: MoE, contextual sparsity, early exiting, speculative decoding, parallel decoding.
  - System level: operator fusion, memory management, workload offloading, parallel serving.
  - Hardware level: spatial architectures, PIM/NMC, new data formats, new processing elements.
- **Discussion topics.** The closing discussion covers safety and reliability, large multimodal models and long sequences. Long-context methods reviewed include StreamingLLM, H2O, Transformer-XL, Compressive Transformer, ALiBi, NTK-aware RoPE, YaRN and Giraffe.
- **Ongoing maintenance.** The paper (arXiv 2402.16363) is announced as a maintained, updated project.

## Interesting ideas
- **Organize a survey around one analytical lens.** Each method is judged by how it changes memory access versus computation, rather than only listed by topic. The same approach could structure literature reviews in other areas, such as data pipelines or treebank tooling.
- **Model prefill and decode separately.** The two stages have very different bottlenecks, so analysing them separately avoids misleading averages. This helps when estimating serving costs for chatbots or batch annotation jobs.
- **Use a config-driven "what-if" calculator.** Describing the model, settings and hardware declaratively, then getting bottleneck and memory estimates, lets you compare deployment options before buying or renting GPUs. This is valuable for small teams on tight budgets.
- **Keep the first tokens when truncating context.** StreamingLLM's observation is that the opening tokens act as anchors for softmax attention. A sink-plus-sliding-window mask can therefore extend usable context without fine-tuning, a cheap trick for long-document processing.
- **Rescale position encodings by frequency.** Giraffe protects the well-trained high-frequency components with a power-law scaling scheme. More generally, how well each part of a learned representation was trained should guide how aggressively it is extrapolated.
